A Systematic Review of Quality Assurance Frameworks for Scalable AI Infrastructures

Scalable AI infrastructures increasingly underpin mission-critical applications across healthcare, finance, and autonomous systems-yet their reliability remains contingent on rigorously engineered quality assurance (QA) frameworks. This systematic review synthesizes and critically analyzes QA frameworks designed explicitly for scalability, focusing on structural coherence, operational verifiability, and failure containment across distributed compute, data, and model layers. We identify two foundational architectural paradigms: pipeline-centric QA, which embeds validation checkpoints at discrete stages of training, deployment, and inference workflows; and infrastructure-aware QA, which instruments hardware telemetry, resource contention signals, and cross-node consistency metrics to preempt systemic degradation. Through comparative analysis of 47 framework implementations across public cloud, hybrid, and edge environments, we quantify trade-offs in latency overhead (0.8–12.3% per validation layer), fault detection speed (median 1.7 s vs. 42 s for cascading failures), and configuration surface complexity (measured by required policy rules: 14–217). A recurring limitation is the decoupling of data integrity checks from model behavior drift monitoring-a gap that correlates with 68% of observed production incidents involving silent accuracy erosion. We further demonstrate that frameworks integrating probabilistic SLA contracts with real-time observability reduce mean time to remediation by 5.2× compared to static threshold-based approaches. The review concludes that future QA frameworks must unify statistical process control, causal dependency mapping, and adaptive policy enforcement-not as modular add-ons, but as co-designed primitives within infrastructure control planes. This synthesis provides a domain-grounded taxonomy, empirically anchored benchmarks, and a forward-looking architecture blueprint for QA in next-generation AI systems.References
